Issue with feature fusion

Hi,

I am attempting to fuse features from colour and visible images using a pre-trained ResNet50 model. It works fine when i train it on colour images and provides decent results, however, when I try to use it in a way to fuse the colour image with thermal images within the network, the model trains fine but then the loss gets stuck around 20%.

I am using matlab to calculate the miss rate, which is quite high, at about 50% and does not seem to decrease. I have tried to increasing/decreasing the learning rate but this not help much.

Based on papers i have read online on this topic, 6-10 epochs should be sufficent to train the model, however this has not been the case for me and i believe it has something to do with the way i am fusing the data.

Please find my fusion code below:

class DeepFusionNetwork(torch.nn.ModuleDict):
    def __init__(self, model):
        super(DeepFusionNetwork, self).__init__()
        self.model = model
        self.conv1 = self.model.body.conv1
        self.bn1 = self.model.body.bn1
        self.relu = self.model.body.relu
        self.maxpool = self.model.body.maxpool
        self.layer1 = self.model.body.layer1
        self.layer2 = self.model.body.layer2
        self.layer3 = self.model.body.layer3
        self.layer4 = self.model.body.layer4
        self.fpn = self.model.fpn
        self.conv2 = nn.Conv2d(1024, 512, kernel_size=(1,1), stride=(1,1), bias=False)

    def forward(self, img1, img2, targets=None):
        out = OrderedDict()
        self.conv2 = self.conv2.to(device)
        x, y = self.conv1(img1), self.conv1(img2)
        x, y = self.bn1(x), self.bn1(y)
        x, y = self.relu(x), self.relu(y)
        x, y = self.maxpool(x), self.maxpool(y)

        x, y = self.layer1(x), self.layer1(y)
        out[0] = x

        x, y = self.layer2(x), self.layer2(y)
        z = F.relu(torch.cat((x, y), dim=1))
        z = self.conv2(z)

        out[1] = z
        z = self.layer3(z)
        out[2] = z
        z = self.layer4(z)
        out[3] = z
        features = self.fpn(out)
        return features

I have also noticed that the model does not output any predicitions unless i use a large number of images for training.

Your code looks generally fine.
I’m not sure, which model you are passing to your custom model, as the torchvision resnet50 doesn’t have a body and fpn module.

Could you explain the last issue a bit more?
Your model should return the features tensor regardless of the used batch size.

Thank you for your reply. I am using the Faster R-CNN example from the pytorch website, which is why there is body and fpn modules.

The issue is, that when I train the model without the fusion layers i.e.

z = F.relu(torch.cat((x, y), dim=1))
z = self.conv2(z)

the model trains fine, however, when I use the fusion layers, the model seems to be training with the loss reducing, however, the predictions are very bad.

Your model should return the features tensor regardless of the used batch size.

Sorry I should have been more clear, I meant to say that when I have a low number of samples in my trainloader, the model does not produce any predictions.

I hope I have answered your questions.

Is the loss reducing in the same range for both approaches or is the second approach significantly worse regarding the loss?
Do you change anything else besides using the mentioned layer?

Is the loss reducing in the same range for both approaches or is the second approach significantly worse regarding the loss?

The loss does reduces similarily in both approaches, however, when i use the feature fusion model, the loss goes to about 30% and does not seem to reduce much further, even when using a lower learning rate for an extended number of epochs. When i use the model without feature fusion, the loss goes down to around 10% in comparison with the same amout of epochs and learning rate.

Do you change anything else besides using the mentioned layer?

Nothing else is changed other than that layer.

I just can’t wrap my head around why the outcomes of the two models are so differnt. I would expect both models to have similar results, however, as i mentioned previously, the fusion-based model doesnt even produce prdictions unless the train loader has at least 1000 samples.

The the “fusion layer” your own implementation to concatenate the output of both images after passing them through a conv layer?
If so, could you check the statistics of these activations?
If they are largely different, you might need to normalize them before concatenating.

Thank you again for your prompt reply.

The the “fusion layer” your own implementation to concatenate the output of both images after passing them through a conv layer?

The “fusion layer” takes places between layer2 and layer3 of the pre-trained resnet50 model. For self.conv2 in my custom DeepFusionNetwork, I am simply reducing the output of 1024, which is generated from the concatenation, to 512, to match the input of layer2 in resnet50.

I hope that this makes sense and that I have done that correctly.

If so, could you check the statistics of these activations?

By this, do you mean something like this?

If they are largely different, you might need to normalize them before concatenating.

In terms of normalisation, I’m assuming you mean something like this (i.e. there is no special means of normalisation required just because I am concatenating features)
